They never turn off completely. They have to consume some power to check if any buttons have been pressed for wakeup, for example, or to detect a nearby headset. Remove the batteries if they are going to be out of use for a long time. This also avoids the possibility of damaging leakage.

Remove the controller batteries for 30 seconds and any additional accessories. Then replace them with a new pair of batteries.
unpair controller from headset.
Hard reboot the headset by holding the power button for 30 seconds.
Re-pair the controller to the headset.
